Through Stochastic process, Random variable and Independence (probability theory)

When analyzing sums, random walks, or other additive functions of independent random variables, one can often apply the central limit theorem, law of large numbers, Chernoff's inequality, Chebyshev's inequality or similar tools. When analyzing similar objects where the differences are not independent, the main tools are martingales and Azuma's inequality.

Definition

Let Y be any random variable with E[|Y|]<∞. Suppose {F0,F1,…} is a filtration, i.e. Fs⊂Ft when s<t. Define

Zt=E[Y∣Ft],

then {Z0,Z1,…} is a martingale, namely Doob martingale, with respect to filtration {F0,F1,…}.

To see this, note that

  • E[|Zt|]=E[|E[Y∣Ft]|]≤E[E[|Y|∣Ft]]=E[|Y|]<∞;
  • E[Zt∣Ft−1]=E[E[Y∣Ft]∣Ft−1]=E[Y∣Ft−1]=Zt−1 as Ft−1⊂Ft.

In particular, for any sequence of random variables {X1,X2,…,Xn} on probability space (Ω,F,P) and function f such that E[|f(X1,X2,…,Xn)|]<∞, one could choose

Y:=f(X1,X2,…,Xn)

and filtration {F0,F1,…} such that

F0:={ϕ,Ω},Ft:=σ(X1,X2,…,Xt),∀t≥1,

i.e. σ-algebra generated by X1,X2,…,Xt. Then, by definition of Doob martingale, process {Z0,Z1,…} where

Z0:=E[f(X1,X2,…,Xn)∣F0]=E[f(X1,X2,…,Xn)],Zt:=E[f(X1,X2,…,Xn)∣Ft]=E[f(X1,X2,…,Xn)∣X1,X2,…,Xt],∀t≥1

forms a Doob martingale. Note that Zn=f(X1,X2,…,Xn). This martingale can be used to prove McDiarmid's inequality.
